"That's what she said" is a lame joke. It's what people say after someone says something that can be taken as double entendre, like "It's nice, but kind of limp".

I have never heard it before. I looked up the history just now and see that it is the British equivalent.
But, growing up in the 80s and 90s means "that's what she said" is practically as ingrained as "ditto" or "jinx, you owe me a pepsi".
